After creating the subscription schedule, I updated the latest invoice with statement descriptor. This worked for that invoice, but then subsequent invoices were back to the default.
Yes you need to update each invoice, you can't configure statement descriptor at Subscription level. You can either to set it at your Stripe Account Level or do it for each created invoice

You can listen to the event invoice.created and update dynamically the invoice statement descriptor.
